Book excerpt: The rise of Deep Learning (DL) and its assistance in learning complex feature representations significantly impacted Reinforcement Learning (RL). Deep Reinforcement Learning (DRL) made it possible to apply RL to complex real-world problems and even achieve human-level performance. One of these problems is related to robotics. Recently, DRL agents successfully learned optimal behavior in a range of robotic environments. The policy can provide much information from its learned representation. However, this policy is approximated using a neural network and, therefore, is a black box. Explainable Artificial Intelligence (XAI) is a new AI subfield focusing on interpreting Machine Learning models' behavior. A large part of XAI's literature has emerged on feature relevance techniques to explain a deep neural network (DNN) output processing on images. These techniques have been extended to explain Graph classification tasks using Graph Networks (GN). Nevertheless, these methods haven't been exploited to analyze the DRL agent's behavior learned to perform in a robotic environment. In this work, we proposed to analyze the representation learned by a DRL agent's policy in a robotic environment. We use graph structure to represent the robot's observation in an entity-relationship manner and graph neural networks as function approximators in DRL. For the interpretation phase, an explainability technique called Layer-wise Relevance Propagation (LRP), a feature relevance technique that had been successfully applied to explain image and graph classification tasks, is used to interpret the learned policy. We evaluate the information provided by the LRP on two simulated robotic environments on MuJoCo. The experiments and evaluation methods were delicately designed to effectively measure the value of knowledge gained by our approach to analyzing learned representations in the Deep Reinforcement Learning task.

Book excerpt: In this thesis, we investigate the connection between the properties and the generalization performance of representations learned by deep reinforcement learning algorithms. Much of the earlier work on representation learning for reinforcement learning focused on designing fixed-basis architectures to achieve properties thought to be desirable, such as orthogonality and sparsity. In contrast, the idea behind deep reinforcement learning methods is that the agent designer should not encode representational properties, but rather that the data stream should determine the properties of the representation--good representations emerge under appropriate training schemes. We bring these two perspectives together, empirically investigating the properties of representations that are good at generalization in reinforcement learning. This analysis allows us to provide novel hypotheses regarding the impact of auxiliary tasks in end-to-end training of deep reinforcement learning methods. We introduce and measure six representational properties over more than 28 thousand agent-task settings. We consider DQN agents with convolutional networks in a pixel-based navigation environment. We develop a method to better understand why some representations improve generalization, through a systematic approach varying task similarity and measuring and correlating representation properties with generalization performance. Using this insight, we design two novel auxiliary losses and show that they generalize as well as our best baselines.

Since current methods typically rely on manually designed solution representations, agents that automatically adapt their own representations have the potential to dramatically improve performance. This book introduces two novel approaches for automatically discovering high-performing representations. The first approach synthesizes temporal difference methods, the traditional approach to reinforcement learning, with evolutionary methods, which can learn representations for a broad class of optimization problems. This synthesis is accomplished by customizing evolutionary methods to the on-line nature of reinforcement learning and using them to evolve representations for value function approximators. The second approach automatically learns representations based on piecewise-constant approximations of value functions. It begins with coarse representations and gradually refines them during learning, analyzing the current policy and value function to deduce the best refinements. This book also introduces a novel method for devising input representations. This method addresses the feature selection problem by extending an algorithm that evolves the topology and weights of neural networks such that it evolves their inputs too. In addition to introducing these new methods, this book presents extensive empirical results in multiple domains demonstrating that these techniques can substantially improve performance over methods with manual representations.
