Book excerpt: Abstract: "In this paper we propose a multiresolution Markov Random Field (MMRF) model for segmenting textured images. The Multiresolution Fourier Transform (MFT) is used to provide a set of spatially localised texture descriptors, which are based on a two-component model of texture, in which one component is a deformation, representing the structural or deterministic elements and the other is a stochastic one. Stochastic relaxation labelling is adopted to maximise the likelihood and assign the class label with highest probability to the block (site) being visited. Class information is propagated from low spatial resolution to high spatial resolution, via appropriate modifications to the interaction energies defining the field, to minimise class-position uncertainty. Experiments on the segmentation of natural textures are used to show the potential of the method."

Segmentation is formulated within an image labeling framework, where the problem is reduced to assigning labels to pixels. In a probabilistic approach, label dependencies are modeled by Markov random fields (MRF) and an optimal labeling is determined by Bayesian estimation, in particular maximum a posteriori (MAP) estimation. The main advantage of MRF models is that prior information can be imposed locally through clique potentials. MRF models usually yield a non-convex energy function. The minimization of this function is crucial in order to find the most likely segmentation according to the MRF model. Classical optimization algorithms including simulated annealing and deterministic relaxation are treated along with more recent graph cut-based algorithms. Image segmentation is a process for dividing an image into its constituent parts. For block-based segmentation using statistical classification, an image is divided into blocks and a feature vector is formed for each block by grouping statistics of its pixel intensities. Conventional block-based segmentation algorithms classify each block separately, assuming independence of feature vectors. Image Segmentation and Compression Using Hidden Markov Models presents a new algorithm that models the statistical dependence among image blocks by two dimensional hidden Markov models (HMMs). Formulas for estimating the model according to the maximum likelihood criterion are derived from the EM algorithm. To segment an image, optimal classes are searched jointly for all the blocks by the maximum a posteriori (MAP) rule. The 2-D HMM is extended to multiresolution so that more context information is exploited in classification and fast progressive segmentation schemes can be formed naturally. The second issue addressed in the book is the design of joint compression and classification systems using the 2-D HMM and vector quantization. A classifier designed with the side goal of good compression often outperforms one aimed solely at classification because overfitting to training data is suppressed by vector quantization. Coarser resolution sample fields are obtained by either subsampling or local averaging the sample field at the fine resolution. Although Markovianity is lost under such resolution transformation, coarse resolution non-Markov random fields can be effectively approximated by Markov fields. We present two techniques to estimate the GMRF parameters at coarser resolutions from the fine resolution parameters, one by minimizing the Kullback-Leibler distance and another based on local conditional distribution invariance. We show the validity of the estimators by comparing the power spectral densities of the Markov approximation and the exact non-Markov measures. We also allude to the fact that different measures (different GMRF parameters) on the fine resolution can result in the same probability measure after subsampling and show the results for the first and second order cases. We apply this multiresolution model to texture segmentation. Different texture regions in an image are modeled by GMRFs and the associated parameters are assumed to be known. Parameters at lower resolutions are estimated from the fine resolution parameters. The coarsest resolution data is first segmented and the segmentation results are propagated upwards to the finer resolution. We use iterated conditional mode (ICM) minimization at all resolutions. A confidence measure is attached to the segmentation result at each pixel and passed on to the higher resolution. At each resolution, ICM is restricted only to pixels with low confidence measure. Our experiments with synthetic, Brodatz texture and real satellite images show that the multiresolution technique results in a better segmentation and requires lesser computation than the single resolution algorithm."

Except in certain special cases, optimizing an MRF is intractable, due to a large number of variables and complex dependencies between them. In this thesis, we present new algorithms to perform inference in MRFs, that are either more efficient (in terms of running time and/or memory usage) or more effective (in terms of solution quality), than the state-of-the-art methods. First, we introduce a memory efficient max-flow algorithm for multi-label submodular MRFs. In fact, such MRFs have been shown to be optimally solvable using max-flow based on an encoding of the labels proposed by Ishikawa, in which each variable $X_i$ is represented by $ ell$ nodes (where $ ell$ is the number of labels) arranged in a column. However, this method in general requires $2 , ell̂2$ edges for each pair of neighbouring variables. This makes it inapplicable to realistic problems with many variables and labels, due to excessive memory requirement. By contrast, our max-flow algorithm stores $2 , ell$ values per variable pair, requiring much less storage. Consequently, our algorithm makes it possible to optimally solve multi-label submodular problems involving large numbers of variables and labels on a standard computer. Next, we present a move-making style algorithm for multi-label MRFs with robust non-convex priors. In particular, our algorithm iteratively approximates the original MRF energy with an appropriately weighted surrogate energy that is easier to minimize. Furthermore, it guarantees that the original energy decreases at each iteration. To this end, we consider the scenario where the weighted surrogate energy is multi-label submodular (i.e., it can be optimally minimized by max-flow), and show that our algorithm then lets us handle of a large variety of non-convex priors. Finally, we consider the fully connected Conditional Random Field (dense CRF) with Gaussian pairwise potentials that has proven popular and effective for multi-class semantic segmentation. While the energy of a dense CRF can be minimized accurately using a Linear Programming (LP) relaxation, the state-of-the-art algorithm is too slow to be useful in practice. To alleviate this deficiency, we introduce an efficient LP minimization algorithm for dense CRFs. To this end, we develop a proximal minimization framework, where the dual of each proximal problem is optimized via block-coordinate descent. We show that each block of variables can be optimized in a time linear in the number of pixels and labels. Consequently, our algorithm enables efficient and effective optimization of dense CRFs with Gaussian pairwise potentials. We evaluated all our algorithms on standard energy minimization datasets consisting of computer vision problems, such as stereo, inpainting and semantic segmentation. The experiments at the end of each chapter provide compelling evidence that all our approaches are either more efficient or more effective than all existing baselines.
