This model makes the notion of abstraction easily applicable by means of the introduction of a set of abstraction operators and abstraction patterns, reusable across different domains and applications. Adaptation in Natural and Artificial Systems is the book that initiated this field of study, presenting the theoretical foundations and exploring applications. In its most familiar form, adaptation is a biological process, whereby organisms evolve by rearranging genetic material to survive in environments confronting them. In this now classic work, Holland presents a mathematical model that allows for the nonlinearity of such complex interactions. He demonstrates the model's universality by applying it to economics, physiological psychology, game theory, and artificial intelligence and then outlines the way in which this approach modifies the traditional views of mathematical genetics. Initially applying his concepts to simply defined artificial systems with limited numbers of parameters, Holland goes on to explore their use in the study of a wide range of complex, naturally occuring processes, concentrating on systems having multiple factors that interact in nonlinear ways. Along the way he accounts for major effects of coadaptation and coevolution: the emergence of building blocks, or schemata, that are recombined and passed on to succeeding generations to provide, innovations and improvements.

Book excerpt: Agent-based models are becoming increasingly useful in studying the behavior of real-world complex multi-agent systems; however, one of the outstanding challenges in the modeling of coupled natural and human systems is the dearth of techniques for creating agents that are able to learn from their past failures and successes, as well as compounded environmental and social uncertainties. This research has been focused on the integration of traditional agent-based modeling with machine learning methodologies for modeling agent decision-making and its recursive impacts on economic, environmental, and societal outcomes, feeding into the dynamic co-evolution of the coupled natural and human system state variables within simulated worlds, resulting in the development of two models incorporating and exploring the use of deep reinforcement machine learning as a driver for decision-policy making in agent-based models. The first of these models is a model of agricultural land use and the adoptionof agricultural best-management practices by farmers in response to ecological and economic scenarios as a result of municipal regulation and variance in the occurrence of extreme weather events. The primary study area used for the model is a region of the Missiquoi Bay Area of Lake Champlain in Vermont, containing 480 farmer agents corresponding to agricultural land parcels within the region. A parameter sweep and sensitivity analysis on model hyperparameters was conducted to explore the effects of changes to agent calibration and training on agent decision-making and model performance. The second model expands upon the scope of the first, including foresteragents and commercial and residential urban agents within a larger region of the Lake Champlain Basin of Vermont. Additionally, the impacts of agent decision-making take place on the simulated landscape, resulting in gradual land cover change over time. Land cover data from the United States Geological Survey's National Land Cover Database was used for initial parameterization, calibration, and training of the model (years 2001, 2006) and model testing (year 2011). Results suggest that with appropriate scoping and hyperparameter selection,the integration of deep reinforcement machine learning techniques into the development of agent-based models can increase predictive accuracy in the modeling of real-world phenomena; however, these gains must be weighed against the increased technical complexity of such a model and the associated risk of introducing model error.

Advances in Geographic Information System (GIS) technology, digitization, online data availability, historic legacy datasets, remote sensors and the ability to collect data on animal movements via satellite and GPS have given rise to large, highly complex datasets. These datasets could be utilized for making critical management decisions, but are often “messy” and difficult to interpret. Basic artificial intelligence algorithms (i.e., machine learning) are powerful tools that are shaping the world and must be taken advantage of in the life sciences. In ecology, machine learning algorithms are critical to helping resource managers synthesize information to better understand complex ecological systems. Machine Learning has a wide variety of powerful applications, with three general uses that are of particular interest to ecologists: (1) data exploration to gain system knowledge and generate new hypotheses, (2) predicting ecological patterns in space and time, and (3) pattern recognition for ecological sampling. Machine learning can be used to make predictive assessments even when relationships between variables are poorly understood. When traditional techniques fail to capture the relationship between variables, effective use of machine learning can unearth and capture previously unattainable insights into an ecosystem's complexity. Currently, many ecologists do not utilize machine learning as a part of the scientific process. This volume highlights how machine learning techniques can complement the traditional methodologies currently applied in this field.

Book excerpt: This dissertation focuses on introducing and developing Machine Learning techniques in complex systems such as renewable energy systems, supply chain networks and quantum optimization. In the third chapter we investigate multivariate forecasting and reconstruction of the missing characteristics of ocean waves based on information from nearby wave sensors. Moreover, we design a new case study based on ocean wave measurement stations along the east coast of the United States and explore the wave feature selection concept.In the fourth chapter, we introduce parallel structures to tackle the above-mentioned tasks. We integrate derivative-free optimization with an ensemble of sequence-to-sequence networks. In addition, we design a new resampling technique called additive resampling which along with bootstrap aggregating (bagging) resampling, are applied to initialize the ensemble structure. The findings indicate that the introduced method performs better when the forecasting horizon becomes longer. In addition, the model represents a clear interpretation of the selected features.In the fifth chapter, we propose a framework that uses deep neural networks to optimize inventory decisions in complex multi-echelon supply chains. We first introduce pairwise modeling of general stochastic multi-echelon inventory optimization. Then, we present a framework which uses DNN agents to directly determine order-up-to levels between any adjacent pair of nodes in the supply chain. Our model considers a finite horizon and accounts for the initial inventory conditions. Our method is suitable for a wide variety of supply chain networks, including general topologies that may contain both assembly and distribution nodes, and systems with nonlinear cost structures. We investigate general supply chain networks and find that the proposed method performs better in terms of both objective function values and the number of interactions with the environment compared to alternate methods.In the sixth chapter, we explore search strategies for the design of parameterized quantum circuits. We propose several optimization approaches including random search plus survival of the fittest, reinforcement learning both with classical and hybrid quantum classical controllers and Bayesian optimization as decision makers to design a quantum circuit in an automated way for a specific task such as multi-labeled classification over a dataset. We introduce nontrivial circuit architectures that are arduous to be hand-designed and efficient in terms of trainability and report meaningful advantages over the benchmarks for the classification tasks supporting the fact that the suggested designs are inherently more trainable.
